Compute in Transit — Presentation 05

Training Transit, Simulated

The goal: compress gradient traffic on the wire without sending indices, with the compression done for free in the link. A fixed frequency band needs no comparisons, so the optics can compute it in transit, and both ends already know which coefficients are sent.

Deck 04 measured how many steps each way of syncing gradients needs to reach a loss, and how many bytes it sends. This deck turns that into wall-clock time and energy, with a SimPy model of eight workers in one or more data centres, and a photonic link module that computes the band in transit, at a worker’s port or at the switch. Where does the module help, and what would it need to break even? In short, at this scale it does not pay: a pluggable module never breaks even, and summing the band at the switch pays only on slow WANs.

Topics We'll Cover

Where this deck sits

Deck 01 sets the budget and the five tests for a photonic link module (arXiv:2608.21536). Deck 02 found the strongest candidate in training. Deck 04 ran the experiment: a fixed band computed in transit, with the optics emulated. This deck simulates what that means in time and energy. Code, tests and every number: Training_Transit_Sim, examples/results.md.

Concepts used here, and where they are explained. Each is defined, with links, in the series glossary.

01

The Question

Deck 04 counted steps and bytes. To reach a loss of 3.158 (the 2-D fixed band’s final loss, the one loss that the dense, top-k, exact-band and optics variants all reach), AdamW and top-k needed 400 steps, the exact fixed band 2,667, and the band through the emulated optics (ENOB 8) 1,800, from one seed. A step count is not a time: a band sends fewer bytes per step, and a module that computes it adds its own time.

Does the convergence result turn into time and energy?

  • How long does each variant take to reach 3.158, on one data centre or several, over fast and slow WANs?
  • How much energy does it use, and how much of it is the module’s?

Where does a link module help?

  • When is the module itself the bottleneck: its port, its optics, its compute budget?
  • What WAN bandwidth, compute budget or ENOB would it need to break even with AdamW, top-k, or the band computed on the GPU?
Measured, assumed and illustrative

Steps to a loss are measured (one model size, 8 workers, 3,000 steps; A to C three seeds, every E run one seed). That the repaired optics band needs fewer steps than the exact band is a hypothesis, so every in-transit result is also given with the exact band’s steps. Two variants were not run and reuse measured steps. Link presets, the MFU and most module coefficients are illustrative and labelled where they are used.

02

The Model

W workers in D data centres, each worker an H100. A step is compute, then one sync of the update; the time to target is steps × step time. The diagram is the 2 DC × 4 topology; the model also runs 1 DC × 8 and 8 DC × 1.

Data centre 1 Data centre 2 GPU 0 GPU 1 GPU 2 GPU 3 switch GPU 4 GPU 5 GPU 6 GPU 7 switch WAN (inter-DC) WAN: 100 GbE, 25 GbE, 400G, 800G or 8 Gb/s intra-DC: InfiniBand NDR 400G, 50 GB/s per worker pluggable module at a worker’s port (E) module at the switch (E′, hypothetical)

Compute: a roofline

6 × parameters × tokens per worker per step, divided by the device’s peak rate × MFU. 15,833,472 parameters, 2,048 tokens per worker per step (8 sequences of 256), MFU 0.40 (illustrative). The top-k and band variants add their forward transform on the GPU.

The sync: hierarchical ring collectives

Intra-DC, then inter-DC, then intra-DC. A ring all-reduce sends 2(N−1)/N × B per worker; a ring all-gather sends (N−1) × P. Each link direction and each module is a SimPy resource; a sync runs round by round, each round paying latency + bytes / bandwidth.

Devices and link presets are imported from Disaggregated_Inference_Sim at 69ffd2b, not copied. The 400G and 800G presets and the 8 Gb/s WAN share (the 100 GbE preset at 1 GB/s) are illustrative. At zero background load the simulated step equals an independent closed form to 1e-12 (a test); slide 06 shows what only the discrete-event model can see. Source: results.md, header and section 2.

Six Variants and Their Wire Bytes

Four variants were measured in deck 04’s experiment. Two are hypothetical: every worker sends the same band positions and DeMo averages before taking the sign, so summing the bands gives the same update as gathering them, and C′ and E′ reuse C’s and E’s steps. They were not run.

Source: results.md, section 1. Model wire = bytes a worker sends in the model’s collective with 8 workers in one DC; for A, B, C and E it equals the experiment’s wire column exactly (a test).

E: the band in a pluggable

Each worker’s dense delta goes through its own module, which computes the band; the band is then all-gathered, so the wire bytes are C’s. A pluggable sees one flow, so it cannot sum.

E′: the band computed and summed at the switch

Each worker sends its dense delta (2 bytes per parameter) up to its switch, where modules compute and sum the band; only the band sum crosses the WAN. The switch also sends each worker its own optical band back (a loopback), because deck 04’s fix feeds back the values actually sent, which an all-reduce would not return. C′ is the same summation done by an ordinary ring all-reduce at the GPUs, no module.

04

The Module as a Link Kernel (Interactive)

The module is modelled as a link kernel: it declares operations per byte by type (FFT, add, multiply, MAC, floating-point MAC, modular, gather), latency, energy per bit and placement. A stream goes through four pipelined stages, and the slowest sets the rate:

port: 25 GB/s (QSFP56) → optics: 4 × 14 Gb/s NRZ, one pass per bit plane → compute budget: 10 to 99 GFLOP/s → FPGA stage (illustrative rate)

From the paper: 9.7 W static, the QSFP56 port, 4 × 14 GBaud NRZ. From the developer’s website: 2.76 pJ/bit (45 nm, excluding the laser). Illustrative: laser power, FPGA rate and work per value, latency, and the 10 and 99 GFLOP/s bracket. Source: results.md, sections 6 and 7b.

Break-even against WAN Bandwidth (Interactive)

Time to 3.158 on 2 DC × 4 as the inter-DC bandwidth changes (the 100 GbE preset’s latency throughout). Move the slider, or pick a recorded point; switch between E’s steps (the hypothesis) and the exact band’s.

How the curves are drawn: on 2 DC × 4 only the sync’s WAN term depends on the bandwidth, B / bw for an all-reduce or the switch sum, 4P / bw for an all-gather, and max(4P / bw, P / 25 GB/s) for a pluggable, whose port caps its flow. The rest of each step is taken from results.json’s 100 GbE step. A build-time check (_cit05_build/slider_model.py) confirms that this reproduces every time-to-target column on 2 DC × 4 and all 28 rows of section 7a.

Bottleneckfail Never breaks even with AdamW or top-k over 0.1 to 1,000 GB/s of WAN.narrow Beats AdamW only below 1.57 GB/s with E’s steps, 0.83 GB/s with the exact band’s.
Budgetfail With the transform charged, module compute binds below 140.0 GFLOP/s, above the 10 to 99 bracket.
Precisionpass ENOB 8 trains; ENOB 6 never reaches a ladder loss.
Placementfail One flow: it cannot sum, and it caps its worker’s port.pass Streams meet at the switch; needs a loopback of each worker’s own band.

Where in-network summing matters

An all-gather of the band still sends 13,854,288 bytes per worker, 0.25 of AdamW’s 55,417,152, while it needs 1,800 steps to AdamW’s 400. Summing is what cuts the WAN traffic: E′ sends only the band sum between data centres, and on a slow, shared WAN that is where it gains (slides 06 and 07).

But the summing does not need the module

C′, the same band computed on the GPU and ring all-reduced, beats AdamW below 6.58 GB/s. With both on the exact band’s steps, E′ never beats C′ in range. Only E’s single-seed step advantage, the hypothesis, lets E′ beat C′ at all.

Verdict

At this scale a photonic link module (arXiv:2608.21536) computing a fixed band in transit does not shorten training: as a pluggable it never breaks even, and at a switch it gains only on slow WANs, where a band summed by the GPUs gains more. The module’s case would need the repaired optics’ fewer steps to hold up over more seeds, a budget above 140.0 GFLOP/s or a free transform, and a switch placement with a loopback.

Limits, Next Steps, and What to Take Away

Limits

  • One model size (15.8M parameters), 8 workers, 3,000 steps; steps to a loss are measured only there, and resolved to the 200-step evaluation interval.
  • Single seeds for every E run: E’s fewer steps, and every E-based crossing, are a hypothesis.
  • C′ and E′ were not run; they assume summing the band gives the same update as gathering it.
  • No compute–communication overlap; a pluggable’s processing and its all-gather run one after the other (conservative).
  • Flows sharing a WAN link in one round are one transfer; background traffic only on the WAN; the intra-DC fabric is non-blocking.
  • Receivers’ inverse transforms and HBM traffic are not costed; E′’s sum is split evenly over the switch’s modules.
  • The optics noise model is the series’ own; most module coefficients are illustrative.

Next

  • More E seeds, to turn E’s step advantage, and every crossing that rests on it, from hypothesis into result.
  • Overlap of compute and communication, and a congested intra-DC fabric.
  • A selection without comparisons that keeps the momentum’s energy (deck 04’s open question): the model takes any bytes and steps.
